Soil isn't uniform, so it erodes slightly in random spots. Then fluid physics happens as explained here. Nifty, right?

Millions as it takes a long time for the river to recede the dirt

it depends on the type of soil and river. it can take a few years, to decades, to centuries.

From a geological perspective, it happens very quickly-- decades. There is a good time lapse showing this process on Ucayali River from Google Earth here: kzitem.info/news/bejne/z32Avqx3k4Kea4I It is also interesting to look at the border between Louisiana and Mississippi; you can see that the border reflects the old course of the Mississippi River, but it has changed dramatically over the past centuries.
